Balancing Privacy, Fairness, and Utility: A New Method for Synthetic Data Generation

Friday 28 February 2025

Synthetic data has become a hot topic in the field of machine learning, especially when it comes to ensuring privacy and fairness in AI systems. Researchers have been working on developing methods that can generate synthetic data that mimics real-world data while maintaining the integrity of sensitive information.

One such method is called DECAF (DEbiasing Causal Fairness), which was recently tested by a team of researchers. They found that DECAF achieved the best balance between privacy and fairness, but at the cost of its predictive accuracy.

To understand how DECAF works, let’s first consider what synthetic data is. Synthetic data is generated artificially using machine learning algorithms to mimic real-world data. The goal is to create data that is indistinguishable from real data, while maintaining the integrity of sensitive information such as personal identifiable information (PII).

DECAF uses a unique approach by incorporating fairness constraints directly into the generation process. This allows it to generate synthetic data that not only resembles real-world data but also ensures that the AI system used to analyze the data is fair and unbiased.

The researchers tested DECAF using three different datasets, including one from the field of education. They found that DECAF was able to generate synthetic data that was highly similar to the original data, while maintaining a high level of fairness and privacy.

However, there were some trade-offs. The researchers found that DECAF’s predictive accuracy suffered as a result of incorporating fairness constraints. This means that AI systems using DECAF-generated data may not be as accurate in their predictions as those using real-world data.

Despite this limitation, the researchers believe that DECAF has significant potential for use in real-world applications. For example, it could be used to generate synthetic data for use in medical research or education, without compromising privacy and fairness.

Another method tested by the researchers was ADSGAN (Adversarial Data Synthesis using Generative Adversarial Networks), which took a different approach by generating synthetic data through a game-like process between two neural networks. This method achieved better predictive accuracy than DECAF but struggled with fairness and privacy.

The study highlights the challenges of developing methods that can balance privacy, fairness, and utility in AI systems. It also shows that there is no one-size-fits-all solution and that different methods may be more suitable for different applications.

As researchers continue to develop new methods for generating synthetic data, it’s clear that DECAF has made significant strides towards ensuring both privacy and fairness in AI systems.
