A new approach has been proposed to enhance the capabilities of large language models (LLMs) in time series analysis, a crucial task in various fields such as finance, healthcare, and energy management. The traditional methods used for time series analysis rely heavily on statistical techniques, which can be limited in their ability to capture complex patterns and relationships.
The researchers have designed a novel paradigm called Context-Alignment, which aligns the time series data with linguistic components familiar to LLMs. This approach enables LLMs to contextualize and comprehend the time series data more effectively, thereby unlocking their full potential in this domain.
Context-Alignment consists of two main components: structural alignment and logical alignment. The structural alignment component uses dual-scale nodes to describe the hierarchical structure of the time series data, allowing LLMs to treat long sequences as a whole linguistic component while preserving intrinsic token features. The logical alignment component employs directed edges to guide logical relationships between tokens, ensuring coherence in the contextual semantics.
The effectiveness of Context-Alignment has been demonstrated through extensive experiments on various datasets, including financial and energy-related time series data. The results show that Context-Alignment outperforms traditional methods and existing LLM-based approaches in terms of accuracy and robustness. Additionally, Context-Alignment exhibits superior performance in few-shot learning and zero-shot learning scenarios, indicating its ability to generalize across diverse datasets.
One of the key benefits of Context-Alignment is its flexibility and scalability. The approach can be easily integrated into various layers of pre-trained LLMs, allowing for fine-tuning on specific tasks or domains.
